I think people who don't speak Japanese project a lot of mystery and coolness onto the language sometimes. People talk about how obviously better the Japanese voice acting is, how the Japanese dialogue moved them more, it's just so much deeper, man, etc, etc...
Though it's not anime, an example would be when the Japanese dubs of My Little Pony: Friendship is Magic were released, there were a lot of comments going nuts over it. The Japanese version of the "This Day Aria" song was highly praised by fans for being "better than the English version".
However, if you actually speak Japanese, it's... okay. It's clearly a bit awkward due to being translated (it's very hard to translate a song and have it fit the same melody), and the whole thing is just kid's show quality in general.
And that's sort of what it's like watching anime after learning Japanese. The mystique is gone and you're able to look at the actual quality of the writing and acting. And anime can vary in quality quite a bit, from masterpieces to complete dreck.
Another thing is, if you're an anime fan, then by the time you actually speak Japanese fluently, you're pretty used to the tropes and cliches that anime uses. And you're also probably at least 5-10 years older than when you started watching. Things that were OMG SO HILARIOUS/AWESOME the first time you saw them are now rather passe or even cringe-worthy. A series has to be something special to impress you by that point.
